This paper presents a comprehensive review of loss functions and performance metrics in deep learning, highlighting key developments and practical insights across diverse application areas. We begin by outlining fundamental considerations in classic tasks such as regression and classification, then extend our analysis to specialized domains like computer vision and natural language processing including retrieval-augmented generation. In each setting, we systematically examine how different loss functions and evaluation metrics can be paired to address task-specific challenges such as class imbalance, outliers, and sequence-level optimization. Key contributions of this work include: (1) a unified framework for understanding how losses and metrics align with different learning objectives, (2) an in-depth discussion of multi-loss setups that balance competing goals, and (3) new insights into specialized metrics used to evaluate modern applications like retrieval-augmented generation, where faithfulness and context relevance are pivotal. Along the way, we highlight best practices for selecting or combining losses and metrics based on empirical behaviors and domain constraints. Finally, we identify open problems and promising directions, including the automation of loss-function search and the development of robust, interpretable evaluation measures for increasingly complex deep learning tasks. Our review aims to equip researchers and practitioners with clearer guidance in designing effective training pipelines and reliable model assessments for a wide spectrum of real-world applications.
Loss functions and evaluation metrics are foundational to deep learning, yet their selection is often ad hoc. This comprehensive survey by Terven et al. addresses a critical gap by systematically reviewing loss functions and metrics across diverse domains, from classic regression and classification to specialized areas like computer vision, NLP, and retrieval-augmented generation (RAG). With 395 citations, it has quickly become a key reference for practitioners seeking to navigate the complex landscape of training objectives and performance measures.
The paper's significance lies in its unified framework that aligns losses with metrics according to learning objectives. This is particularly valuable as deep learning models grow more complex and multi-faceted. By highlighting best practices and empirical behaviors, the survey provides actionable guidance for designing training pipelines that are both effective and reliable. Moreover, its focus on modern applications like RAG—where faithfulness and context relevance are pivotal—demonstrates its relevance to cutting-edge AI systems.
As a survey, the paper does not present new experimental results but synthesizes findings from existing literature. It systematically examines how different loss functions and metrics can be paired to address task-specific challenges. For instance, it discusses the trade-offs between losses like cross-entropy and focal loss for class imbalance, and metrics like precision-recall and AUC-ROC. The survey also highlights the importance of sequence-level optimization in NLP and the need for specialized metrics in RAG, such as those measuring faithfulness and context relevance. These insights are drawn from a wide range of studies, providing a comprehensive overview of empirical behaviors.
The broader impact of this survey is twofold. First, it serves as a practical guide for researchers and practitioners, helping them navigate the myriad of loss functions and metrics available and make principled choices. This can lead to more efficient training and more reliable model assessments. Second, by identifying open problems and future directions, it stimulates further research in areas like automated loss-function search and interpretable evaluation. In an era where deep learning models are increasingly deployed in real-world applications, such guidance is essential for ensuring robustness and trustworthiness. The paper's emphasis on modern applications like RAG also ensures its relevance to contemporary AI challenges, making it a valuable resource for the community.
